Overview

Abstract

Speech representation learning requires a discrete modeling interface while preserving high waveform fidelity. Existing approaches rarely achieve both: discrete tokens ease modeling but lose fine-grained acoustic information, while continuous latents preserve fidelity but require specialized generative objectives. We introduce SemiCodec, a novel Semi-discrete neural speech Codec with synchronized discrete tokens and continuous latents. Direct joint optimization may create a reconstruction shortcut through the continuous pathway, leaving the discrete tokens insufficiently grounded. To address this issue, we propose a Preserve-then-Ground training paradigm that first establishes a high-fidelity synthesis space and then grounds SSL-guided discrete tokens within it. Experiments show that SemiCodec outperforms fully discrete codecs in reconstruction quality and intelligibility while remaining competitive with continuous representations in acoustic fidelity and speaker preservation.

Semi-discrete representation

One codec, two synchronized views of speech

Discrete tokens capture SSL-guided information, while continuous latents preserve speaker identity, prosody, and fine waveform detail.

SemiCodec architecture and Preserve-then-Ground training paradigm
Model architecture and Preserve-then-Ground trainingSemiCodec encodes speech into synchronized SSL-guided discrete tokens and continuous acoustic latents, maps both branches into a shared synthesis space, and fuses their decoded features by addition for waveform reconstruction. Stage I trains the continuous pathway to preserve acoustic detail; Stage II freezes the learned acoustic representation and grounds the discrete branch with waveform and SSL supervision, while Acoustic Dropout encourages the waveform decoder to use the discrete stream.

Key ideas

01

Discrete tokens

A 25-Hz discrete stream with a 4,096-entry codebook provides a compact discrete representation.

02

Continuous latents

A synchronized 64-dimensional continuous stream retains information that is difficult to express through a single codebook.

03

Staged training

The training paradigm prevents the continuous path from becoming a reconstruction shortcut that leaves discrete tokens underused.
